Lubuntu 18.10 - Xbox One controller not automatically reconnecting via Bluetooth

When I pair the controller for the first time, everything is fine, the controller is paired, it works and is recognized by jstest and emulationstation.

The problems happen when the controller gets disconnected (eg. PC suspend/shutdown, turning off the controller). After turning on the controller, the connection is never made, and the controller does not show up in the BlueDevil Wizard. To get it to work, I have to run bluetoothctl and use the remove command in order unpair the device, thus making the controller show up in the BlueDevil Wizard - then I can successfully connect again.

But that's bothersome. Is there a way to fix this?

Controller: Xbox One Controller, model 1708

Bluetooth adapter: ASUS BT-400
